Executive Summary

This benchmark evaluates both traditional novelty detection methods and novel SetFit-based methods that leverage contrastive learning embeddings. The key finding is that using SetFit-trained embeddings for novelty detection significantly outperforms traditional approaches.

Findings

  • Zero-shot works well when class names are semantically distinct (e.g., "Sports", "Business")
  • Head-only underperforms due to limited training (only logistic regression head)
  • Full SetFit achieves best accuracy by fine-tuning embeddings via contrastive learning

Why SetFit-Based Methods Work Better

Traditional Embeddings (Frozen)

Pre-trained embeddings create loose, overlapping clusters:

SetFit-Trained Embeddings (Contrastive Learning)

Contrastive learning creates tight, well-separated clusters:

Novel samples fall OUTSIDE these tight clusters, making them easier to detect.


Ensemble Methods

  • Adaptive weights consistently outperforms fixed weighted average on both datasets
  • ag_news: 0.946 vs 0.944 (+0.2%)
  • go_emotions: 0.785 vs 0.768 (+1.7%)
  • Voting underperforms weighted methods — majority voting is too strict for this domain
  • Ensembles trade DR@1% for broader coverage (higher DR@5%, DR@10%)

Meta-Learner

  • Implemented in SignalCombiner with logistic regression
  • Falls back to weighted average when no trained model exists
  • Requires training on labeled OOD data

Adaptive Weights

Rule-based adjustments based on dataset characteristics: - Class separability → increase centroid weight - Sample density → increase kNN weight - Low samples → decrease LOF/OneClass weight - High dimensionality → increase uncertainty weight


Metric Definitions

AUROC (Area Under ROC Curve)

Measures overall discrimination ability. 1.0 = perfect, 0.5 = random.

DR@1% (Detection Rate at 1% False Positive)

At 1% of known samples incorrectly flagged as novel, what % of novel samples are caught? SetFit Centroid achieves 16.6% vs traditional best of 2.3% (+15x improvement).
